This doesn't seem to happen anymore. Also from what I've learned you shouldn't have to start Pulse Audio manually. Instead it should be started automatically whenever an application needs it. I think DBus might handle this. Which explains why it is working now, bc I just recently started running DBus and now I don't have this issue.
Make a service which starts the Pulse Audio Daemon.
Right now after boot I have to run the following to make Audio work in certain applications like Discord:
