rgb and depth features fusion #10

I am taking inspiration from your project to extend Detectron2 defaults for my project. The feature I want to add is just to create a new backbone that has 2 parallel Resnet, one resnet extracts RGB feature maps, the other resnet extracts Depth feature maps. At the end their features are fused before being feeded to the common FPN. This is exactly the same as you do. Then instead of your architecture I use a standard maskRcnn. The problem is that using your convolutional fusion the network is not able to learn well and I get a very strange result in the end as you can see in the picture.

Can you explain me how can I fuse the tensors representing rgb and depth feature maps using your other method (sum) instead of a Convolution layer? I understand that I should change in the config file the MODEL.FUSE_TYPE to "add" but I am not sure in how should I modify also this part). Should I just eliminate the references of the fusion layers in the class and do the summation in the forward pass or what? Thanks for your time

Interesting problem! To fuse the rgb and depth features with summation, set cfg MODEL.FUSE_TYPE to add as you did and you don't need to change any other parts of codes. However, in our cases, concatenation yielded slightly better performance than summation. You can also try early fusion (single backbone and concatenated input) by setting cfg.MODEL.RGBD_FUSION to early. (But late fusion typically performs better than early fusion)

By the way, fusion method may not be the reason for the low performance... maybe you can try to adjust the learning rate and DEPTH_RANGE or set to CLS_AGNOSTIC_MASK to False ?

I have already tried early fusion and it performs good, but in my case it is slightly better just using an RGB model. Now I am looking for other ways as using your late fusion model for RGB-D feature fusion and I am trying to insert it. This is the model I can build taking inspiration from UOAIS:

The fusion_layers visible at the start remain the same either if I use "conv" or "add", so I was thinking if it would be possible to change this part) in order to create just fusion_layers where I do a simple operations on tensor (and not a Conv layer as displayed by Det2 training log). For example I would like to create a "weighted add" fusion where I give more weights to RGB features (e.g bottom_up_features[k] = 0.75*self.bottom_up_rgb_features[k] + 0.25*self.bottom_up_depth_features[k_depth] here)

Then to add more info I tried also a smaller learning rate and data augmentation since my dataset is very small, but my simple maskrcnn with this backbone can't properly learning. In fact the total loss decrease for a while (200 iters), then increases very slowly. I have to add that I have a very small dataset of 50 images and this may be the cause of that, or probably I am missing to add some important step of your pipeline

RGB backbones are initialized with the pre-trained weight from ImageNet, but depth backbones are not. Does the RGB-D model predicts well in the training set but performs weirdly in the test set?

In that case, you can consider initializing the depth backbone with the weights from ImageNet or UOAIS-SIM, as 50 training images are insufficient to learn good depth features.

Also, check whether the INPUT.DEPTH_RANGE is set appropriately.

perfect, so I can use as an example the "add" fusion case and do some operation for feature fusion on tensors directly as you have done

Does the RGB-D model predicts well in the training set but performs weirdly in the test set?

My validation loss calculated on validation set decreases, but when I evaluate the model with the COCOevaluator my network has very bad results through the whole training even if AP becomes slightly better (validation loss is calculated the same as training loss but on validation set)

Then using my test set at the end of the training I reach an AP50 of 0.04 with the training metrics displayed above. Instead when using early fusion I get good results for the validation set from the 200th iteration more or less and I reach 0.66 AP at the end of the training. The results are slighly better than before but still quite disappointing, I will try to do a longer training and check if it converges.

I am left with some questions: -It could be that the anchor generations influence the whole result when setting them as SIZES: [[16], [32], [64], [128], [256]] ? the standard config applies all anchors as this [[32, 64, 128, 256, 512]], don't tried yet though.

-why do you use 3 channels for the depth image and not one? is this due to the fact that you load pretrained weights for both backbones?

-Can you point me to where the bottom up backbones weights are loaded in the code?

I reduced the anchor sizes as the image size is 640x480 and the objects are quite small. COCO image sizes are around 1333x800 and It would be better to adjust the anchor sizes according to your image size.

We used a 3 channel for the depth image following the SD Mask R-CNN paper. I think the reason for this is to make it easy to use the pre-trained weights from ImageNet. Whether you are using one-channel or three-channel inputs, The performance should be similar.

We did not use the pre-trained weights for the depth backbone. Pretrained weights for RGB backbone are loaded by detectron2's DefaultTrainer.resume_or_load (check the fvcore.common.checkpoint._load_model. As I understand, this function loads the weights by matching the name of the network layers and pre-trained weights.

You may need to implement the additional load functions to initialize the depth backbones with the ImageNet weights, and I think this may improve the RGB-D model's performance as you are using only 50 training images. Using a UOAIS-Net backbone would be an easier option if you are using exactly the same depth backbone.

Yes I am using the same backbone (RGBD_FPN), maybe just some names are changed . Do you mean that I could go to your Gdrive, download the .pth weights and load them to my model to start from them? Also I am considering to train some other RGB-D dataset and use them as a starting base for my dataset, but is your UOAIS-Sim annotated like COCO annotations?

Yes. But be aware that depth range of UOAIS-SIM can be different with yours, which can reduce the performance.

Yes. UOAIS-Sim follows COCO annotation format, but indoor dataset like NYU RGB-D would be a better choice than ours.

Hi @SeungBack, at the end using your weights as initialization to my backbone I managed to get very good results on my dataset. With the best run for the architecture with no initialized weights I get 0.31 of AP, instead with initialized weights from your gdrive (rgbd_concat) I get 0.71 AP! Instead with Nyuv2 I get slightly worse results (0.55). The RGB only model still win, but in fact looking at my depth image It can be seen that It lacks good features to be learned since the grape bunches mix together with leaves and there is no a clear distinct shape, but the only visible and distinct shape is the one at the bottom where the floor is more distant with respect to the grape bunch. If I will take some other measures on-field I will make sure to take them very close to the grape bunch and with a lot more of precision in the depth.
